What was the judgement of Paris?

The “Judgement of Paris” was a 1976 wine tasting organized by Steven Spurrier that pitted Napa Valley wine against the creme de la creme of French wine. As documented in a Time magazine article about the wine-tasting event, Napa Valley was not known at the time as the wine-producing powerhouse it is today. In fact, virtually everyone who participated assumed the French wines would win the tasting contest. If you were not previously aware of the Judgement of Paris, you’re probably guessing what happened. You guessed it! Napa Valley produced wines won the competition.

The cabernet sauvignon tasting was won by Stag Leap Wine Cellars. The chardonnay tasting was won by Chateau Montelena. While the monumental importance of this result to the wine world took some time to be realized (press presence at the event was a single Time magazine reporter), this event put Napa Valley on the global wine map. Heck, there is even a movie about it.

Weather and Wine Quality

It’s generally understood by wine critics that weather conditions during the growing season affects wine quality. The first quantitative study relating weather conditions to wine quality was published by Orely Ashenfelter in 2008. The paper compared the price of Bordeaux Grand Cru (i.e., the premier wineries of Bordeaux) wine producers to the weather conditions that evolved during the growing season of each vintage using linear regression. One of the weaknesses the original analysis is that the weather data was not normalized. This means the relative importance of temperature and precipitation during different times of growing season to wine quality can’t be easily compared.

The First Quantitative Weather vs. Wine Quality Study

World Wine Weather published an updated analysis of Ashenfelter’s wine quality paper. We normalized the weather data to allow intercomparison of the variables. The updated results show the most important variable to Bordeaux wine quality is summer temperatures. A warmer-than-normal summer produces better cabernet sauvignon. The amount of rainfall during winter months is important as well. Winter precipitation recharges the soil moisture in preparation for the warm summer months. And temperature and precipitation during harvest is important. Warmer-than-normal harvest temperatures helps the grape concentrate it’s water content intensifying the flavor. Lower-than-normal precipitation has the same effet.

The Most Recent Weather vs. Wine Quality Study

An interesting peer-reviewed paper made the wine news in October of 2023. The study was published by Andew Wood, of the University of Oxford. The paper’s title is “Seasonal weather impacts wine quality in Bordeaux.” This study is similar to the Ashenfelter paper but, instead of using the price of wine as the quality indicator, it uses a published history of Bordeaux wine critic wine ratings and weather data. The weather data is the ECMWF Reanalysis Version 5 (ERA5), which is itself interesting because ERA5 is a modeled weather data in which the solution is forced to known weather observations.

The results of this paper (see this image – a summary of results) show that greater than normal winter precipitation and summer temperature are beneficial to wine quality. Likewise, it shows that below-normal temperatures and precipitation during Autumn (i.e., harvest time) are beneficial to wine quality. This autumn result is different than what the Ashenfelter paper and our rework of the study show.

The Ashenfelter and Wood studies have conflicting results. Both agree that lower than normal precipitiation during Autumn improve wine quality. However, Ashenfelter suggests warmer-than-normal temperatures during Autumn improve wine quality while Wood’s suggests the opposite. Our rework of the Ashenfelter paper agrees that warmer temperatures are better and suggests that above normal precipitation before harvest improves wine quality. In our study, however, the coefficient is quite small. Because the data is normalized, the magnitude of the coefficient indicates its relative importance. In other words, the importance is relatively small, which is supported by Woods figure 2B graphic as well.

A Napa Valley Cabernet Sauvignon Quality Index

Using the research information about how weather during the year impacts wine quality, I propose two wine quality indices. These indices will be used to compare the weather that occurred in Napa Valley from 1965 to 2023. The index combines each of the wine season weather parameter into a single number (the index) allowing years to be inter compared.

Napa Wine Climate During the Judgement Years

The graphic below shows the normalized seasonal averaged precipitation and temperature in Napa Valley from 1965 to 1974. The years highlighted in red are the vintage years of the different Napa Valley cabernet sauvignons.

Values above zero mean the temperature or precipitation was above normal (normal is defined as 1965 to 2020 in this case). Values below zero mean the temperature and precipitation were below normal.

The Napa Valley Wine Quality Index

The Napa Valley wind quality index is evaluated in two ways. The first is an equal weighted index.

Index = 0.25 * Winter Precipitation + 0.25 * Summer Precipitation + 0.25 * Summer Temperatures + 0.25*Harvest Temperatures.

The index uses normalized data from each of the “seasons” used in the equation. In this case:
Winter = November, December, January, February, and March contiguously. The November and December are from the prior year.
Summer = July, August, September
Harvest = October, which is generally when cabernet sauvignon is harvested in Napa Valley.

The second version of the index uses the information from the two aforementioned studies. In this case, the index is:

Index = 0.2 * Winter Precipitation + 0.3 * Summer Precipitation + 0.4 * Summer Temperatures + 0.1*Harvest Temperatures.

The second version of the index gives more importance to summer time (i.e., the core of the wine grape growing season) than the other seasons.

Climate of the Judgement of Paris Napa Valley Wines

The index is calculated for each year from 1965 to 2023 using the proposed weights above. The results are shown below.

The equal-weighted index shows the 1969 to 1973 years were decent but not exceptional years when compared to the full history of data. According to this index, 1986 was the best Napa Valley wine climate year since 1965. Wine-searcher.com say the 1986 Napa Valley vintage was “spectacularly good.” This suggests the index is valid.

The seasonal weighted index shows some differences for the Judgment years but 1972 and 1973 are still high index value years. 1986 is still rated as the best year in the history. The ranking of each index and the Judgement years is shown below. The 1973 seasonally weighted index, which according to the research referenced, should be a better indication of wine quality, is ranked 15th out of the 58 years.

It’s interesting to note the winning Cabernet Sauvignon wine is the 1973 Stags Leap Cellars. How much of the perceived quality of that wine was due to the excellent growing weather conditions of 1973? How good was 1970 relative to other years in Bordeaux? That question will be answered in a separate post.

The wine quality index results suggest the outcome of the tasting may have been different if differnt Napa Valley vintages were selected.

The Marlborough, New Zealand wine region is known for its bright sauvignon blancs. The region arrived on the international wine scene in 1985 when David Hohnen and Kevin Judd launched Cloudy Bay and their wines received rave reviews.  The terrior of the region is the culture, geography, and climate that make a wine region unique.  The Marlborough region’s climate is one aspect of its uniqueness. 

Marlborough Wine Region Climate Data

The Marlborough Research Centre maintains weather stations in Blenheim and Awatere and both have relatively long histories.   This post focuses on the data from the Blenheim station.  The first published observation from the station was March 1st, 1996. 

The data is available as one Excel file per year.  I used an R script to sort through the different naming conventions to create one long consistent daily weather observation history for the Blenheim weather station.

Marlborough Wine Region Climate: Precipitation

The monthly average precipitation using the daily weather observations from 1986 to 2022 are shown below. The monthly averages range from approximately 75 mm to 120 mm, which makes is moderately dry. The graphic shows the lowest monthly rainfall and January is the driest month in Blenheim. The lowest rainfall in January is 0.4 mm, essentially no rainfall at all.

Marlborough Wine Region Climate: Temperatures

Monthly average temperatures at the Blenheim station in the Marlborough wine region are shown below. Wintertime temperatures in July average just above 10°C while summertime temperatures average just below 20°C. These temperatures are cooler than other regions such as Bordeaux, which averages approximately 22 °C, and Albemarle, Virginia in the USA, which averages approximately 25°C.

The graphic also depicts the maximum and minimum temperature recorded in each month over the 1986 to 2022 history. January daily temperatures have reached approximately 37°C.

Marlborough Wine Region Climate Change

Have temperatures at the Blenhiem station been increasing over time? To answer this we examine two pieces of data. The first is the warmest maximum temperature and the coldest minimum temperature recorded in each month of the history. We then used a linear regression against time to estimate if the data includes a trend or not. Interestingly, the trend of the monthly maximum of maximum temperatures is 0.0029 °C per month. Likewise, the trend of the minimum of the monthly minimums is 0.0023 °C degrees per month. Over the 25 year history of data the warmest monthly temperatures have increased almost 0.9°C and the coldest monthly temperature have increased 0.7°C.

Another analysis is to look at the percentage of days within each month greater than a certain threshold. The graphic below shows the percentage of days each month temperatures are greater than 25°C. While not tested statistically, visually, there is no dramatic increase in the percentages.

The Marlborough region is on the northern end of New Zealand’s south island. It is likely any temperature increases due to climate change are currently being ameliorated by the nearby ocean.

Conclusion

This post presents the climate of the Blenheim, NZ in the Marlborough Wine Region as measured by the Wine Research Center in Blenheim. The climate is frequently described as cool and the data bears that out. The data suggest that temperatures are increasing slightly as the impacts of climate change are likely being ameliorated by the nearby ocean.

The Ashenfelter wine quality index created waves of controversy in the wine industry when it was released. In the June 2008 edition of The Economic Journal, Princeton economist Orley Ashenfelter published “Predicting the Quality and Prices of Bordeaux Wine.” You can read the article here. The premise of the article is that weather conditions during the Bordeaux wine season play a substantial role in establishing each vintage’s quality, as indicated by its market price.

This information had been in the market for some time, however. For example, a 1990 New York Times article discusses his finding. His work eventually gained Dr. Ashenfelter visibility because of the conflict it seemingly created with wine experts such as Robert Parker. Mr. Parker is quoted in the NYT article calling Dr. Ashenfelter’s premise “ludicrous and absurd.”

Predicting the Quality and Prices of Bordeaux Wine

Growing grapes to produce wine is an agricultural activity. This means the weather conditions during the growing season impacts the final quality of the product once it’s in the bottle. Ashenfelter’s paper is a regression-based analysis of relating the price of premier Bordeaux wines to the weather conditions (i.e., the Bordeaux wine climate) during a specific vintage.

The 1990 and 1991 prices of London auction wine price data for wines produced in the 1950s to 1980s were secured along with weather data from the Bordeaux-Merignac airport. Regression analysis demonstrates the importance of weather conditions to the quality of the Bordeaux wine, which is assumed to be reflected in its price. The idea that emerges is that the quality of a Bordeaux vintage can be predicted using weather data alone.

The Original Work

The regression analysis in the article demonstrates the price of the premier Bordeaux wines can be modeled using the following equation:

A key aspect of this equation is the first term. It says the quality of wine increases with age. This comes as no surprise to anyone familiar with evaluating and drinking Bordeaux’s premier wines.

It turns out the data used in the study has been published online and used in a statistics tutorial. Since it’s readily available I’ve accessed it and used it in the remainder of this post.

The red line shows the result of linear regression on only the age of the vintage versus it’s age.

The paper only lightly documents the methodology of the analysis. For example, the source of the weather station data is not provided. The data for the Bordeaux-Merignac airport is certainly available if one digs deep enough and is willing to pay for it.

Bordeaux Weather: A Different Source

In this post, I seek to recreate the results of the regression analysis but also reformulate the wine quality index based on what I perceive as a few shortcomings of the methodology. For Bordeaux weather data, I reanalysis data rather than the observed weather station data. Reanalyses, such as the ECMWF ERA5, is a numerical recreation of observed weather data using modern weather forecast modeling technology. The model is run for earlier dates and the solution is forced by the known weather station, radiosonde, satellite, and other sources of observed weather conditions. The ERA5 data is available from 1950 to today.

How valid is it to use the ERA5 data? To answer that, I recreate Figure 2 from the Ashenfelter paper. It shows the relationship between “Summer Temperature” and “Harvest Rain.” Given the regression coefficient descriptions in the paper, I assume this means the April to September temperatures and the September total precipitation.

The graphic below recreates Ashenfelter’s Figure 2. In this case, the temperature and precipitation data have been “centered,” meaning the time-series average of both variables has been removed. Each data point style displays if the original price of the wine that year was above or below normal. We see (note the Y-axis is reversed) that relatively warm summers and lower than normal harvest precipitation generates higher than normal prices.

Using the ERA5 data we can apply Ashenfelter’s equation to look at the quality of more recent Bordeaux vintages. In this case, the first component of the equation relating the age to price is not used. In other words, I’m applying the second through the fifth regression coefficients to a history of ERA5 data to estimate the quality of Bordeaux red wine in each year up to 2020.

The index time series shows that higher-quality wines have happened more frequently in the past 20 years than in the prior 40 years. Recall the largest coefficient in the regression equation was applied to the growing season temperature term. The index, therefore, is particularly sensitive to changes in temperature.

The recreation of Ashenefelter’s Figure 2 shown above uses data only from 1952 to 1980. We can add the years after 1980 to the graphic.

In this case, each data point is labeled by the last two digits of the year and color-coded to represent the years greater than 1980 in blue. The majority of blue dots are to the right of the red dots meaning the growing season temperatures were higher than the group of years used to create the original graphic. In other words, the wine-growing season average temperatures have increased over the past 70 years. And, because the regression equation is dominated by the growing season temperature term and the summers are warming the quality index gradually increases.

It might be necessary to reformulate Ashenfelter’s regression.

Revisiting Ashenfelter’s Wine Quality Index

Unfortunately, the paper does not provide much detail regarding analytical methodology. But we can infer quite a bit of information from the graphs and the regression results shown. For example, it appears the data was not normalized before being used in the regression analysis. Normalization of the data removes the average value of each variable’s time series and divides it by its standard deviation. The result is a data set in which the average of each time series is zero and the values represent the deviation in standard deviations.

The regression equation as presented in the paper makes it difficult to compare the relative importance of one term relative to another. In other words, is the summer average temperatures more or less important than the harvest total precipitation? We don’t know because the data is normalized.

Normalizing the data and calculating the regression again allows us to compare the relative importance of the different factors. We’ll recalculate the regression results but we want to isolate the impact of weather on wine quality. To achieve that goal we’ll first correct the original wine pricing data for its time dependency.

Correcting the Price of Wine for Time

The first graph of this post shows the relationship between the age of the vintage and the price of the wine. Ashenfelter regression documents that the slope of the red line is that the price changes by 0.0354 GBP for each year of vintage age. We can use this information to control for the impact of age on the price of wine.

Correcting the wine price data for age removes the age dependency. What remains in the price data is theoretically the impact of weather conditions on the quality of the red wine.

Updated Regression

The regression results below are calculated using the time-correct wine auction pricing data but with the ERA5 weather data for Bordeaux.

Because the data was normalized before being used in the model, we can compare the relative importance of the regression coefficients to predict the quality of Bordeaux white wine. The coefficients have been rounded to facilitate the presentation. The most important factor determining the price of Bordeaux wine is growing season temperature, followed by winter precipitation, then September temperatures, followed by August precipitation.

The results are interesting. Above normal precipitation during the winter and in August are negative factors for price. Growing season and September temperatures are positive factors for price. The negative coefficient on winter precipitation is opposite to the finding of Ashenfelter in the original paper.

The original Ashenfelter paper suggests a slightly positive impact of increased wintertime precipitation. This result suggests winter precipitation does not help to increase wine prices.

Bordeaux Wine Quality: A New Formula

Using the wine price regression results with the ERA5 weather data for Bordeaux yields a new formula to estimate Bordeaux wine quality. That formula is:

Using this new formula we create a new wine quality index that is independent of the age of the vintage and includes the relative importance of the weather factors. It is shown below. Note the new formula suggests the August precipitation has almost no importance relative to the other factors.

The new index still suggests the more recent vintages are of higher quality than prior vintages. This is certainly because the average growing season temperatures have increased since the 1950s and 1960s. Comparing this graph to the index based on Ashenfelter’s regression results, however, we see less impact from temperatures in recent years because the index values are not quite as extreme.

The new Bordeaux red wine quality index suggests 2003 is the best year on record and that 2020 and 2018 are not far behind. Does that hold true? The Wine Cellar Insider describes the 2003 vintage as a “scorched, hot, dry growing season.” Bordeaux experienced extreme temperatures in 2003 and the revised index is certainly picking up that signal in the growing season average temperature.

The Buyer, however, quotes Guy Seddon as saying “Bordeaux 2020 is good. It’s really good. But coming hot on the heels of two strong vintages, we’re going to need some convincing.” So, at least there is an indication from Guy Seddon the index is working and accurately assess wine quality in recent years.

The index also ranks 1990 as a decent year. The Wine Spectator gives the 1990 Chateau Latour (which I’ve had the pleasure of enjoying) 100 of 100 points and listed it as the #1 wine released in 1993. Further evidence that while the index contains useful information temperature trends may make the index less useful.

Temperatures in the Bordeaux region are going to increase for the rest of our lifetimes. At some point, the increasing temperatures will become damaging to Bordeaux’s red wine quality. That factor is not represented in the regression equation.

Finally, it might be helpful to rank the years of the index.

The US Alcohol and Tabacco Tax and Trade Bureau regulates wine production in the United States. In that function, they produce a set of interesting wine production statistics. The format of the data is inconvenient (two PDFs with different layouts depending on the year and month), but with a bit of data science, I’ve managed to collate the data for analysis.

According to the data, the United States produced 722.5 million gallons of bottled wine in 2020. Annual wine production from 2012 to 2020 is shown in the table below.

The data is monthly, so we can examine wine production by month. Overall wine production has been increasing over time. Using linear regression, we estimate the annual increase in wine production is approximately 56,700 gallons per year.

California is by far (shown below) most significant wine-producing state. The graphic below shows California produces 47 million gallons of wine per month, although there is month-to-month variations. The lighter blue line depicts the slope of the increase of wine production in California. Wine production in California is increasing at 643,000 gallons per year since 2012.

The US Alcohol and Tobacco Trade Tax Bureau maintains a list of approved wine grape names for use on labels by US vintners.

Based on current regulations, a wine producer must follow these rules regarding the use of grape names on a bottle of wine:

  1. They may only use grape variety names approved by TTB.
  2. If they use a grape varietal name, an appellation of origin must also appear on the label. The name of a single grape can appear on the label if the wine is made of at least 75% of that grape, although there are exceptions.
  3. The wine must be made from a minimum percentage of the grape varietal.
  4. They may use two or more grape varietal names on the label as long as those two grapes are the only grapes used to make the wine.
